Today, phishing attacks are among the most common methods threatening cybersecurity, and the success of machine learning-based detection approaches is directly related to the quality of the features used, model parameters, and classifier architecture. In this thesis, a multi-stage evaluation methodology is proposed that addresses Feature Selection (FS), Hyperparameter Optimization (HPO), and Ensemble Learning components within an integrated experimental framework for the detection of phishing websites. The study utilized the Vrbancic Phishing, UCI Phishing Websites, Hannousse Phishing, and Balanced Mendeley Phishing datasets. In the feature selection stage, ANOVA, Mutual Information, and Recursive Feature Elimination were employed; for hyperparameter optimization, Optuna, Hyperopt, and Scikit- Optimize were used; and for ensemble learning, Voting, Confidence-Based, and Stacking structures were compared. Random Forest and Support Vector Machine models were evaluated as base classifiers, and Accuracy, Precision, Recall, F1-score, and ROC-AUC metrics were jointly used for performance assessment. The experimental results demonstrated that the integrated framework achieved the highest performance on the UCI and Hannousse datasets, with F1-scores of 0,9773 and 0,9677, respectively. In contrast, among the baseline models, the Random Forest model performed better on the Vrbancic dataset, while on the Balanced Mendeley dataset, the structure employing only HPO achieved superior performance. These findings reveal that complex modeling approaches do not automatically provide superior performance across all datasets. The results indicate that performance in phishing detection varies depending on the compatibility between dataset characteristics and methodological components. Consequently, this thesis presents a guiding comparative and modeling framework for real-time phishing detection systems and institutional security solutions.
